Designing Eval Datasets and Success Criteria
Step 2 of 9 in Bootcamp IV: Evaluation & Adversarial Testing.
Why This Step Exists
Step 1 built your instrument calibration. You now understand what an eval score can and cannot tell you, what construct validity means, how contamination undermines measurement, and why Goodhart’s law makes benchmark scores untrustworthy when they become targets. That understanding is necessary but not sufficient. Before you can score anything, you need something to score against.
This is Step 2 because dataset construction determines everything downstream. The scoring method (Step 3), the eval infrastructure (Step 5), the adversarial tests (Step 6) - all of them operate on datasets. A sophisticated scorer running against a poor dataset produces confident wrong answers. A crude scorer running against a well-constructed dataset produces useful signal. The dataset is the load-bearing component.
This is also the hardest part of evaluation. Anthropic notes that BBQ (Bias Benchmark for QA) “took the developers ~2 people years spread over 6 months across 8 people to build” (Ganguli et al. 2023, footnote 1). That is not a typo. Two person-years for a single benchmark. The questions had to be hand-written, validated, pilot-tested, and revised across nine social dimensions. The scoring had to be verified (and as Step 1 showed, the initial scoring still produced a misleading result). Most evaluation failures are not scoring failures - they are dataset failures. The wrong questions were asked, or the right questions were asked to the wrong distribution, or the edge cases were missing, or the data drifted while the eval stayed fixed.
The concepts in this step are established. Train/test splits, class balance, representative sampling, edge case testing - these predate LLM evaluation by decades. What is specific to LLM evaluation is the application domain: open-ended text generation, multi-turn conversation, tool use, code generation. These tasks make dataset construction harder because the space of valid outputs is large and the boundary between “correct” and “incorrect” is often fuzzy. A classification dataset has a finite label set. A code generation dataset has an infinite set of valid solutions. The principles are the same. The implementation is harder.
The goal of this step is practical. By the end, you should be able to: define precise success criteria for an eval, construct a dataset that tests what you claim it tests, design edge cases that discriminate between “works in the demo” and “works in production,” generate synthetic eval data responsibly, and maintain a versioned dataset over time. The worked example uses the slopodar taxonomy from this project - a real anti-pattern classification task with real detection heuristics - to demonstrate every concept concretely.

1. Success Criteria Design
Estimated time: 35 minutes
An eval without success criteria is an observation, not a measurement. You are watching the model produce output and noting what happens. That can be useful for exploration, but it is not evaluation. Evaluation requires a criterion: a statement of what “good enough” looks like, precise enough that two people applying the criterion to the same output would agree on whether it passes.
The progression from vague to precise is where most eval designs fail. Consider these three statements about a sentiment classification task:
- Vague: “The model should classify sentiments well.”
- Better: “The model should achieve high accuracy on sentiment classification.”
- Precise: “F1 score of at least 0.85 on a held-out test set of 10,000 diverse Twitter posts, with per-class F1 no lower than 0.75 for any of the three classes (positive, negative, neutral).”
The first statement cannot be evaluated. “Well” has no operational definition. Two engineers reading this statement would test different things and disagree about whether the model passed.
The second statement is directional but not measurable. “High accuracy” on what data? Measured how? What threshold separates high from not-high?
The third statement is testable. It specifies the metric (F1), the threshold (0.85 overall, 0.75 per-class), the dataset characteristics (10,000 items, diverse source, three classes), and the data discipline (held-out). Given this criterion, two engineers running the same eval will produce the same pass/fail result.
The Anthropic Framework
Anthropic’s eval documentation provides a framework for success criteria that is practical and well-grounded. The criteria should be (Anthropic, “Define success criteria and build evaluations”):
Specific. The criterion names exactly what is being measured and under what conditions. “Accuracy on medical questions” is not specific. “Accuracy on 500 USMLE Step 1 practice questions in multiple-choice format” is specific.
Measurable. The criterion can be computed from the eval output without subjective interpretation. If the criterion requires a human to read each output and make a judgment call, it is not measurable in the strict sense (though it may still be valuable - see Step 3 on human grading). Measurable criteria use metrics with defined computation procedures: accuracy, F1, ROUGE-L, exact match, or a threshold on a defined rubric scale.
Achievable. The threshold is within the range of plausible model performance. A criterion of “100% accuracy on 10,000 questions” is not achievable for any current model on any non-trivial task. Setting unachievable criteria wastes eval cycles and produces no useful signal. The criterion should separate “acceptable for deployment” from “not acceptable,” not “perfect” from “imperfect.”
Relevant. The criterion measures something that matters for the actual use case. A sentiment classifier that will be deployed in a customer feedback pipeline should be evaluated on customer feedback data, not movie reviews. A code generation model that will be used for Python should not be evaluated primarily on Java. Relevance connects the eval to its purpose.
Anthropic demonstrates that even “hazy” topics can produce precise criteria. Their example: “Less than 0.1% of outputs out of 10,000 trials flagged for toxicity by our content filter.” Toxicity is subjective. But the criterion is measurable: run the content filter, count the flags, compute the rate. The subjectivity is pushed into the content filter’s definition of “toxic,” which can be separately validated. This decomposition - breaking a subjective property into a measurable proxy - is a core skill in eval design.
From Use Case to Criteria
The practical workflow starts with the use case, not the metric.
1. State the use case. “Customer support chatbot answering billing questions from a 50-article knowledge base.”
2. Identify failure modes. Incorrect billing information (financial risk), fabricated policies (legal risk), unnecessary refusals (poor experience), rude responses (brand risk), slow responses (abandonment).
3. Convert each failure mode to a measurable criterion.

4. Validate joint achievability. A criterion set where every individual criterion is achievable but the combination is not is a design error. More caution reduces hallucination but increases refusals. The criteria must be achievable simultaneously.
Task-Specific Criteria Examples
Different task types require different criteria structures:
Summarisation - ROUGE-L >= 0.35 (baseline coherence), factual consistency >= 95% (claims supported by source, via NLI or LLM judge), length compliance 90% within target range, zero hallucinated entities per 100 samples. ROUGE-L alone is insufficient - two equally good summaries can score very differently if they use different vocabulary.
Code generation - Functional correctness >= 85% (pass test suites), 100% syntax validity, zero critical/high security findings per 100 samples, >= 90% linter compliance. Functional correctness is necessary but not sufficient - Step 1’s “right answer wrong work” pattern applies here.
Classification - Overall accuracy >= 90%, per-class F1 >= 0.80, no confusion matrix cell exceeding 5%. The per-class F1 prevents a classifier that achieves 90% accuracy by always predicting the majority class.
AGENTIC GROUNDING: When you define success criteria for agent-generated outputs, distinguish between the agent’s capability and the system’s performance. An agent that generates correct code 85% of the time but runs in a loop with self-correction may achieve 95% end-to-end correctness. The criteria should specify which level you are measuring: single-shot model capability, agent-loop performance, or full-system performance with human review. Conflating these levels produces misleading results.
FIELD MATURITY: ESTABLISHED - Success criteria design is established practice in software testing (IEEE 829), quality assurance, and educational measurement. Anthropic’s framework for LLM eval criteria adapts these established practices to the LLM domain. The “specific, measurable, achievable, relevant” structure predates LLM evaluation by decades.
2. Multidimensional Criteria
Estimated time: 30 minutes
Real use cases are never one-dimensional. A customer support chatbot is not just “accurate” or “inaccurate.” It must be accurate, fast, polite, consistent, and safe - simultaneously. A code generation model must produce correct, readable, secure, and efficient code. A summarisation system must be faithful, concise, and relevant.
Multidimensional evaluation means measuring several quality dimensions simultaneously and defining success criteria for each. Anthropic’s eval documentation makes this explicit: “Most use cases require evaluating along several axes simultaneously.”
The Dimensions
Here are the common evaluation dimensions, with definitions precise enough to build criteria from:
Task fidelity. Does the output accomplish the stated task? This is the primary dimension - if the model does not do what was asked, nothing else matters. For a classification task, this is accuracy. For code generation, this is functional correctness. For summarisation, this is whether the summary captures the source material’s key points.
Consistency. Does the model produce similar outputs for similar inputs? If you rephrase a question three ways, do you get semantically equivalent answers? Inconsistency means the eval is partly measuring prompt sensitivity. Measurable via cosine similarity between response embeddings (threshold >= 0.85).
Relevance. Does the output address the input directly? Relevance is distinct from correctness. An output can be correct but irrelevant (answering a different question) or relevant but incorrect (addressing the right question wrongly).
Tone. Does the output match the intended style? “Professional” is vague. “No slang, no contractions, no casual language, responses begin with direct acknowledgment of the question” is specific. Measurable by classifier or LLM judge with a rubric.
Privacy preservation. Does the output avoid leaking sensitive information from context? Binary and safety-critical.
Context utilisation. Does the model use the provided context effectively? If given a knowledge base article, does the response draw from the relevant section, or generate from training data? Measure by comparing responses with and without context on questions where the context contains the answer. If the model gives the same answer either way, it is not using the context.
Latency. How long does the model take to respond? For interactive applications (chatbots, code assistants), latency matters. For batch evaluation (analysing 10,000 documents), it matters less. Latency criteria should specify percentiles, not averages: “P95 < 3 seconds” is more informative than “average < 1 second” because averages hide tail latency.
Cost. What does each evaluation run cost? Token usage determines cost. A model that achieves 95% accuracy with 500-token responses is cheaper to run than one that achieves 96% with 2,000-token responses. Whether the extra 1% accuracy is worth the 4x cost depends on the application.
Weighting and Combining Dimensions
When you have criteria across multiple dimensions, you need a strategy for combining them into a pass/fail decision. Three approaches:
Minimum threshold per dimension (conjunctive). Every dimension must meet its threshold. If any dimension fails, the overall eval fails. This is the most conservative approach and is appropriate when all dimensions are independently important.
PASS if:

This is the pattern used by the project’s quality gate: pnpm run typecheck && pnpm run lint && pnpm run test. Three independent checks, all required. Any
single failure blocks the change. The gate makes no distinction between a typecheck
failure and a test failure - both are blockers.
Weighted composite score (compensatory). Dimensions are weighted and combined. A weakness in one dimension can be compensated by strength in another. Appropriate when dimensions are not independently critical. Danger: a composite of 0.87 could mean excellent accuracy with terrible tone.

Hybrid (conjunctive with composite). Hard minimums on critical dimensions, weighted composite on the rest. The most practical approach: safety-critical dimensions get hard thresholds, quality dimensions get weighted composites.

Defining Weights
Weights should come from stakeholder priorities, not from mathematical convenience. Rank dimensions by importance, assign relative weights summing to 1.0, then validate with a thought experiment: “If dimension A is at threshold and dimension B is excellent, does the output pass?” If the answer surprises you, adjust the weights. Document the weights and reasoning - undocumented weights become implicit assumptions that drift.
SLOPODAR: “Analytical lullaby” - a composite score of 0.91 across five dimensions sounds rigorous. But if the weights were chosen to produce a passing score on the current model and the per-dimension breakdown is buried in an appendix, the composite is performing confidence without delivering information. Always report per-dimension scores alongside the composite.
AGENTIC GROUNDING: Agent systems add dimensions that static model evaluation does not cover. Tool use correctness (did the agent call the right tool with the right arguments?), loop termination (did the agent stop when it should have?), resource usage (how many API calls did the agent make to solve the problem?), and state management (did the agent corrupt shared state?). These are not model quality dimensions - they are system quality dimensions. Design criteria for both levels.
3. Dataset Construction

A dataset is a collection of eval cases, each consisting of an input and an expected output (or criteria for evaluating the output). The quality of the dataset determines the quality of the evaluation. This section covers the principles of constructing datasets that measure what you intend them to measure.
The JSONL Format
The standard format for eval datasets in the LLM ecosystem is JSONL (JSON Lines): one JSON object per line, newline-delimited. JSONL is simple, streamable, diffable in version control, and supported by every major eval framework.

The input field is a list of messages (matching the chat API format). The ideal
field is the expected output. For classification tasks, ideal is the expected label.
For open-ended generation, ideal may be a reference answer used for scoring.

The input field is a plain string (or a message list). The target field replaces
ideal. The optional metadata field carries additional information for analysis -
category, difficulty, source, provenance.
Both conventions work. The choice depends on the framework you use. For this bootcamp, we use the Inspect AI convention because it supports metadata and integrates cleanly with the Inspect evaluation framework covered in Step 5. Converting between formats is straightforward.
Representative Sampling
A dataset should represent the distribution of inputs the model will encounter in production. This sounds obvious. In practice, it is the most commonly violated principle in eval design.
Representative sampling means three things match production: topics (if users ask about billing, refunds, and account changes, include all three in production proportions), difficulty (include easy, moderate, and hard questions in realistic proportions - a dataset of only easy questions inflates accuracy), and phrasing (if real users write “cant access acct pls help,” your dataset should include inputs written that way, not only grammatically perfect queries).
Class Balance
For classification tasks, class balance refers to the distribution of labels in the dataset. Imbalanced classes are common in real data (fraud detection is ~0.1% positive, spam is ~50% positive, sentiment is often skewed toward positive) and must be handled explicitly in dataset design.
The problem. If your dataset has 900 positive examples and 100 negative examples, a model that predicts “positive” for every input achieves 90% accuracy. The accuracy number looks good. The model is useless for detecting negative cases.
The approach. Design your dataset with class balance appropriate to your evaluation goal:
- Natural proportion - use the same class distribution as production data. Good for estimating production accuracy. Poor for evaluating performance on minority classes.
- Balanced - equal examples per class. Good for evaluating per-class performance. Poor for estimating production accuracy (overweights rare classes).
- Stratified - guarantee a minimum number of examples per class, but preserve approximate natural proportions. A practical compromise.
The choice depends on the eval’s purpose. For a deployment-readiness eval (will this work in production?), natural proportion is appropriate. For a capability eval (can the model handle this class at all?), balanced is appropriate. For a comprehensive eval, run both and report both.
Sample Size Guidance
How many eval cases do you need? The answer depends on what you are measuring and what precision you need.
Rough capability assessment: 50-100 examples. Sufficient to distinguish “works” from “does not work.” At 50 examples, a 95% confidence interval for proportion 0.80 is roughly [0.67, 0.90]. Wide, but directional. Appropriate for early development and prompt engineering iteration.
Deployment-quality evaluation: 500-2,000 examples. Narrow enough to be actionable. At 1,000 examples, a 95% CI for proportion 0.90 is roughly [0.88, 0.92].
High-stakes evaluation: 5,000-10,000+ examples. Required for safety evals, bias benchmarks, and detecting small performance differences with statistical significance.

The rule of thumb: Anthropic states: “More questions with slightly lower signal automated grading is better than fewer questions with high-quality human hand-graded evals.” Volume compensates for per-item noise. Per-item quality does not compensate for insufficient volume.
Building a Dataset in Practice
Here is a minimal toolkit for constructing and validating JSONL datasets:

The infrastructure comes in Step 5. Here, the focus is on the data itself.
AGENTIC GROUNDING: When constructing eval datasets for agent systems, the “input” is not just a text prompt. It may include a tool configuration, an environment state, a conversation history, and a goal statement. The dataset must capture the full input context that the agent receives, not just the user’s message. If you reduce the input to a single string, you are testing something different from what the agent encounters in production. Serialize the full context into the dataset entry, even if it makes the JSONL lines long.
FIELD MATURITY: ESTABLISHED - Dataset construction for supervised learning is textbook machine learning (Bishop 2006, Murphy 2012). JSONL as a dataset format is a de facto standard adopted by OpenAI evals, Inspect AI, and most LLM eval frameworks. The principles (representative sampling, class balance, train/test splits) are established. Their application to open-ended LLM evaluation is emerging.
4. Edge Case Design
Estimated time: 35 minutes
Typical cases tell you whether the model works under normal conditions. Edge cases tell you whether the model works under abnormal conditions. In production, abnormal conditions happen routinely. Users send unexpected inputs. Data arrives in unexpected formats. Questions reference topics the model was not trained for. The boundary between “typical” and “edge” is where “works in the demo” diverges from “works in production.”
Edge case design is the practice of systematically identifying and constructing test inputs that exercise boundary conditions, failure modes, and unusual scenarios. The goal is not exhaustive coverage - the space of possible inputs is infinite. The goal is discriminating coverage: edge cases that differentiate a robust model from a fragile one.
A Taxonomy of Edge Cases
For LLM evaluation, edge cases fall into several categories. Each category tests a different failure mode.
Irrelevant input. The user sends input unrelated to the task. A billing chatbot receives “What is the meaning of life?” The correct behaviour is a polite redirect. The failure mode is hallucinating a task-domain answer.

Adversarial input. Prompt injection, jailbreak attempts, social engineering. The model should not comply with attempts to override its instructions.

Ambiguous input. Genuinely unclear input where the correct behaviour is clarification, not guessing. Tests whether the model acknowledges uncertainty.

Overly long input. Tests context window handling and the “lost in the middle” effect (L3 in the layer model). The failure mode is ignoring important content buried in a long input.
Topic shifts. The conversation abruptly changes subject. Tests conversation tracking coherence.

Sarcasm and mixed signals. Surface meaning contradicts intended meaning. “Oh great, another billing error.” The model should recognise frustration, not respond to the literal “great.”
Boundary values. Inputs at the exact boundary of defined behaviour: 4,095 tokens vs 4,097 in a 4,096-token window. Borrowed from software boundary value analysis.
Empty or minimal input. Empty strings, whitespace, single characters. Common in production (users accidentally hitting enter).

Systematic Edge Case Generation
Ad hoc edge case generation is unreliable. You think of the obvious cases, miss the non-obvious ones, and end up with coverage that reflects your imagination rather than production reality. Systematic generation uses a framework to ensure coverage across categories.
The process:
Step 1: List the edge case categories applicable to your task. Not all apply to all tasks - a classification task has no topic shift issues.
Step 2: For each category, generate at least 3 examples at different severity levels: mild (unusual but reasonable input), moderate (clearly abnormal but not adversarial), and severe (maximally adversarial or pathological).
Step 3: Define expected behaviour for each edge case. The criteria are often “does not fail” rather than “produces specific output”: does not crash, does not comply with adversarial instructions, does not hallucinate task-domain content for out-of-scope inputs, requests clarification for genuinely ambiguous inputs.
Step 4: Set the proportion of edge cases. A dataset with no edge cases hides failure modes. A dataset of only edge cases tells you nothing about typical performance. A common split: 70% typical cases, 20% mild edge cases, 10% severe edge cases. Higher-risk applications warrant more edge cases.

SLOPODAR: “Shadow validation” - an eval that covers easy cases thoroughly but skips the critical path. A dataset of 500 typical examples and 0 edge cases is shadow validation applied to eval design. The abstraction (the accuracy number) covers the easy performance while hiding the hard performance. Edge cases are the critical path.
AGENTIC GROUNDING: For agent systems, edge cases include tool failures (API returns 500, file does not exist, database is locked), state corruption (agent writes to a file it already deleted), and infinite loops (agent retries a failing action indefinitely). These are not input edge cases - they are environment edge cases. Your eval dataset for agent systems should include environment configurations that trigger these failure modes, not just unusual user inputs.
5. Synthetic Data Generation
Estimated time: 35 minutes
Hand-writing eval examples is slow. BBQ took two person-years. You do not have two person-years. Synthetic data generation - using LLMs to produce eval examples from a small set of hand-written seeds - is a practical way to scale dataset construction.
But synthetic data has a fundamental limitation: the generated examples inherit the biases and distribution of the generating model. If you use a model to generate test data for itself, you are testing whether the model can recognise its own patterns. This is the “ouroboros” problem identified by Anthropic: model-generated evaluations inherit model biases.
The practical question is not whether to use synthetic data (for many applications, you must - hand-writing thousands of examples is not feasible) but how to use it responsibly.
When Synthetic Data Helps
Volume - 1,000 examples needed, time for 50. Coverage expansion - filling underrepresented subcategories. Format variation - generating typos, abbreviations, non-standard formatting from well-formed seeds. Multilingual expansion - translation from English seeds with validation.
When Synthetic Data Hurts
Distribution shift. LLM-generated text is more regular, less idiosyncratic, and more “average” than human-written text. The model may perform differently on synthetic vs real inputs.
Model-specific artifacts. If you evaluate Claude on a dataset generated by Claude, you may be testing self-consistency rather than task capability.
Systematic blind spots. The generating model shares blind spots with the evaluated model (especially within the same model family). Edge cases that neither handles well will be underrepresented.
Label noise. If the generating model assigns incorrect labels, those errors propagate into your eval dataset.
The Practical Workflow
The responsible workflow for synthetic data generation has five steps:
Step 1: Hand-write 20 seed examples.
These are your highest-quality examples. Each one should be carefully constructed, correctly labelled, and representative of the intended distribution. Include at least one example per class and a few edge cases. These examples define what the dataset should look like.
Step 2: Generate 200 synthetic examples.
Use the seed examples as few-shot demonstrations in a generation prompt. Be explicit about the distribution you want.

Step 3: Validate a sample.
Do not trust the generated examples blindly. Sample 20% (40 examples from 200) and manually check:
- Are the labels correct?
- Are the inputs realistic?
- Is the difficulty distribution reasonable?
- Are there near-duplicates?
- Do the examples exhibit the distribution shift problems described above?
Track your validation results: for each sampled example, record whether the label is correct, the input is realistic, and whether it is a near-duplicate of a seed. Report the rates. A label accuracy below 85% on the validation sample means the generation prompt needs revision.
Step 4: Measure distribution quality.

If the distributions diverge significantly, regenerate with more explicit distribution instructions or post-process to resample.
Step 5: Merge and tag.
Combine hand-written and synthetic examples, tagging each with a source field in
metadata (hand_written or synthetic). Shuffle the merged set. The source tag is
important: when you analyse eval results later, you can check whether the model performs
differently on hand-written vs synthetic examples. A large performance gap suggests the
synthetic examples have different characteristics from the hand-written ones.
SLOPODAR: “Monoculture analysis” - if both the generating model and the evaluated model are from the same model family (e.g., both Claude), the synthetic examples and the eval responses share the same priors. The generator’s blind spots become the eval’s blind spots. Use a different model family for generation than for evaluation when possible.
AGENTIC GROUNDING: The “ouroboros” problem (Ganguli et al. 2023) is an instance of the L10 limitation from the layer model: “N agents from same model != N independent evaluators. Precision increases, accuracy does not.” When one model generates the eval data and the same model family is evaluated against it, you have a single-model pipeline masquerading as independent evaluation. The L11 principle applies: “One sample from a different distribution > N additional samples from the same distribution.” Use a different model to generate synthetic eval data.
6. Held-Out Test Sets
Estimated time: 25 minutes
A held-out test set is a subset of your eval data that is never used during development. It exists for one purpose: to provide an unbiased estimate of performance after all prompt engineering, model selection, and system tuning is complete.
The principle is simple. If you test against the same data you used to develop your system, the performance estimate is biased upward. The system has been tuned to perform well on that specific data. A held-out test set, unseen during development, provides a performance estimate that has not been inflated by this tuning process.
The Split
The standard approach divides data into two sets:
- Dev set (70-80%): Used during development for prompt engineering and iteration. You run against this set frequently and make changes based on results.
- Test set (20-30%): Used exactly once, at the end, to report final performance. You do not make changes based on test set results.
A three-way split (train / dev / test) is needed only for fine-tuning. For prompt engineering, the two-way split is sufficient.

Use the stratified split for classification tasks. It ensures each class appears in both sets in approximately the same proportions. A random split on a small dataset could put all examples of a rare class into one set only.
The Temptation to Peek
The held-out test set only works if you do not peek. “Peeking” means looking at test set results during development and making changes based on what you see. Every peek converts the test set into a dev set. The progression is insidious: you run the test set to “just check,” see a failure pattern, adjust the prompt, run again to verify, and have now fitted to the test set. Each step is locally reasonable. The cumulative effect is a biased estimate.
Mitigations: (1) Discipline - do not run the test set until done developing. (2) Physical separation - store it in a different location. (3) Multiple test sets - use one for periodic checks, reserve the second as the true held-out. (4) Automatic logging - log every test set run; if the log shows 20 runs during development, the final score is suspect.
Data Contamination Revisited
Held-out test sets connect to the content contamination problem from Step 1. If your test set is published, it may appear in future model training data - held out from the developer but baked into the model’s weights. For private eval datasets, the solution is simple: do not publish the test set. Share your methodology and scoring code, but keep the test data private.
AGENTIC GROUNDING: When evaluating agent systems iteratively (running the agent, checking results, adjusting the agent configuration, repeating), every eval run against the same data is a form of peeking. If you have run 50 development iterations against the same 100 eval cases, the agent’s performance on those 100 cases is an overestimate. Keep a separate held-out set for final evaluation, and run development iterations against the dev set only.
FIELD MATURITY: ESTABLISHED - Train/test splits and held-out evaluation are established machine learning practice, dating to the 1990s at minimum. The specific application to LLM prompt engineering (where “training” means iterative prompt adjustment rather than weight updates) is a direct adaptation of the same principle. Cross-validation, bootstrap estimation, and other resampling methods are alternatives when data is scarce, but simple train/test splits remain the dominant practice in LLM evaluation.
7. Dataset Versioning and Maintenance
Estimated time: 25 minutes
Eval datasets are not static. The domain evolves, new failure modes are discovered, and the model under evaluation changes. A dataset built in January may be incomplete by June - not because it was poorly constructed, but because the world changed.
Dataset maintenance is the practice of keeping eval datasets current, versioned, and auditable. It is the least exciting part of eval design and one of the most important.
Why Datasets Drift
Domain drift. The domain changes. A customer support dataset built before a product redesign references features that no longer exist. The dataset’s construct validity degrades as the gap between dataset and current domain widens.
Capability drift. The model improves. Previously hard edge cases become trivially easy. The eval becomes less informative over time.
Discovered blind spots. Production reveals failure modes the original dataset did not cover. These discoveries should feed back into the dataset.
Label errors. Deeper understanding reveals that some original labels were wrong.
Version Control
For small to medium eval datasets (hundreds to low thousands of examples), plain git is sufficient. JSONL files are text, line-oriented, and diff-friendly. Each line is an independent example, so adding or modifying an example produces a clean diff.

Naming convention: Use _v{N} suffixes. Do not overwrite previous versions. When
you update a dataset, create a new version file and document what changed. Previous
versions remain available for comparison and reproducibility.
For large datasets (tens of thousands of examples or more), use Git-LFS or DVC (Data Version Control). These tools store large files outside the git repository while maintaining version tracking through git.
When to Update vs When to Create New
Update when fixing label errors, adding coverage for the same task, or the task definition is unchanged. Create new when the task definition, evaluation purpose, or domain changed significantly. The distinction matters: results from different versions of the same dataset are comparable; results from different datasets are not.
The CHANGELOG
Every dataset version should have a changelog entry explaining what changed and why. The changelog is brief:

SLOPODAR: “Stale reference propagation” - a dataset that references old state while the model and domain have moved on. If your eval dataset still tests against a feature you deprecated six months ago, every “failure” on those items is a stale reference, not a real failure. The model is being penalised for not knowing about something that no longer exists.
AGENTIC GROUNDING: Agent eval datasets drift faster than model eval datasets because agents operate in environments that change. API versions update, tool interfaces change, and the knowledge bases agents query get modified. Version your environment configuration alongside your dataset. A dataset entry that says “call the weather API” is meaningless if the API changed its response format since the dataset was created.
8. Worked Example: Slopodar Eval Dataset
Estimated time: 40 minutes
This section constructs a real eval dataset for a real classification task: detecting slopodar patterns in text. The slopodar is a taxonomy of anti-patterns observed in LLM output during this project’s operation. It contains 34 pattern entries across nine categories: prose style, relationship/sycophancy, analytical/measurement, tests, code, governance/process, metacognitive, and commit workflow.
The eval task is: given a text passage, classify which slopodar pattern (if any) it exhibits.
This is a classification problem with 12 target classes (11 slopodar patterns + “none”). It has properties that make it a good worked example for dataset design:
- The taxonomy is documented with concrete detection heuristics.
- The boundary between patterns is sometimes ambiguous (a passage can exhibit multiple patterns, or be borderline between a pattern and “none”).
- The patterns were observed in real LLM output, so the input distribution is LLM text - which is exactly what models generate.
- The “none” class (clean text) must be represented to prevent the eval from rewarding models that always find a pattern.
NOVEL: Using the slopodar taxonomy as the basis for an eval dataset is novel from this project. The slopodar was built as an operational anti-pattern catalogue, not as an eval benchmark. Constructing an eval dataset from it demonstrates the principle that domain-specific taxonomies with concrete detection heuristics are natural candidates for eval dataset construction. The detection heuristics become the eval criteria, and the trigger examples become the seed data.

This example is important. It contains numbers (like tally voice), describes methodology (like epistemic theatre could), and presents positive results (like analytical lullaby could). But it is clean: the numbers are necessary, the prose is direct, and the limitations are stated. A good eval includes examples that test the classifier’s ability to distinguish genuine content from pattern instances.
Edge Cases
Edge cases for the slopodar eval fall into three categories: multi-pattern passages, borderline cases, and false positives.
Edge Case 1: Multi-Pattern (Epistemic Theatre + Epigrammatic Closure)

Multi-pattern passages force a design decision. For single-label classification, choose a primary pattern and note the secondary in metadata. For multi-label, identify both. This worked example uses single-label classification.

Dataset Statistics
The target distribution for a 50-example dataset: each of the 11 pattern classes gets 2-6 examples (~5-10% each), with the “none” class at 10-15 examples (~23%). Total across all pattern classes: ~35 examples. Total “none”: ~15 examples.
The “none” class is deliberately overrepresented relative to any single pattern. Most real text does not exhibit slopodar patterns. Without “none” examples, the eval rewards models that always predict a pattern. The difficulty distribution should skew toward medium and hard - easy examples confirm recognition; medium and hard examples test discrimination.
From Worked Example to Exercise
This worked example provides the first 10 examples. Challenge 2 asks you to complete the dataset to 50 examples. The principles - hand-written core guided by detection heuristics, edge cases for boundary conditions, “none” examples for specificity - apply to any classification eval dataset.
NOVEL: The slopodar eval dataset is a novel contribution from this project. The taxonomy itself was built through operational observation of LLM anti-patterns (not through academic research or crowdsourced annotation). The detection heuristics were developed iteratively, tested against real outputs, and refined based on false positive and false negative analysis. Using this operational taxonomy as the basis for a formal eval dataset demonstrates a path from operational observation to evaluation infrastructure that is, to our knowledge, not documented elsewhere.
AGENTIC GROUNDING: The slopodar eval dataset tests a capability that matters for agent governance: can the system detect when its own output exhibits known anti- patterns? This project uses the slopodar in the verification pipeline - adversarial review stains code and prose against the taxonomy. An eval dataset for the slopodar is evaluation infrastructure for the verification pipeline itself. When the pipeline’s detection accuracy degrades (Step 9, continuous evaluation), this dataset provides the measurement instrument.
9. Key Concepts / Vocabulary
These terms are used throughout this bootcamp. You should be able to define each from memory before proceeding to Step 3.
Success criteria. A precise, measurable statement of what “good enough” looks like for an evaluation. Must be specific (names what is measured), measurable (can be computed), achievable (within plausible performance range), and relevant (connected to the actual use case). Source: Anthropic eval documentation.
Multidimensional evaluation. Evaluating model output along several quality dimensions simultaneously (accuracy, consistency, tone, latency, cost, etc.). Most real use cases require multidimensional criteria because a single metric cannot capture overall quality.
JSONL (JSON Lines). A text format where each line is a valid JSON object. The standard format for eval datasets in the LLM ecosystem. Streamable, diffable in git, and supported by OpenAI evals, Inspect AI, and most frameworks.
Representative sampling. Constructing a dataset whose input distribution matches the distribution the model will encounter in production. Includes topic coverage, difficulty distribution, and phrasing style.
Class balance. The distribution of labels in a classification dataset. Imbalanced classes can produce misleading accuracy numbers. Strategies: natural proportion, balanced, or stratified sampling.
Edge case. An input at or beyond the boundary of expected behaviour. Categories: irrelevant input, adversarial input, ambiguous input, long input, topic shifts, sarcasm, empty input, boundary values. Edge cases discriminate between “works in the demo” and “works in production.”
Synthetic eval data. Eval examples generated by an LLM from a set of hand-written seed examples. Helps with volume and coverage expansion. Risks: distribution shift from real data, model-specific artifacts, systematic blind spots, label noise.
Distribution shift. The difference between the statistical properties of synthetic (or training) data and real production data. LLM-generated text is more regular and less idiosyncratic than human-written text. Performance on shifted data may not predict performance on real data.
Held-out test set. A subset of eval data never used during development. Provides an unbiased estimate of final performance. Violated by “peeking” (running the test set during development and making changes based on results).
Dev set (development set). The eval data subset used during development. Performance on the dev set overestimates true performance because the system has been tuned to it.
Dataset versioning. Numbered versions with changelogs. Plain git for small datasets; Git-LFS or DVC for large ones.
Dataset drift. Degradation of dataset relevance over time due to domain changes, capability improvements, or discovered blind spots.
10. Challenges
Estimated time: 60-90 minutes total
These challenges exercise the concepts from this step. They build evaluation data and criteria, not evaluation infrastructure (that comes in Step 5). Each one requires a text editor, Python, and access to an LLM API.
Challenge 1: Multidimensional Success Criteria for a Code Review Agent
Estimated time: 20 minutes Type: Design
Define multidimensional success criteria for a code review agent. The agent receives a pull request diff and generates review comments. It should identify bugs, suggest improvements, flag style violations, and ask clarifying questions where appropriate.
Your criteria must include at least 4 dimensions with quantitative targets. For each dimension:
- Name the dimension.
- Define what it measures precisely.
- State the metric and threshold.
- Explain how the metric is computed (code-based, LLM judge, or human evaluation).
- Identify one failure mode the metric would miss.
Deliverable: A criteria document (table or structured text) with 4+ dimensions.
Design constraints:
- At least one dimension must be measurable by code (no LLM or human judge required).
- At least one dimension must require human or LLM judgment.
- The criteria must be jointly achievable (not contradictory).
Evaluation criteria: The dimensions should be independent (each measures something the others do not). The thresholds should be justified (not arbitrary round numbers). The failure modes should be non-trivial.
Design guidance
Starting dimensions to consider: bug detection precision (% of flagged bugs that are real), actionability (% of comments specific enough to act on), coverage (% of known bugs found), comment relevance (% of comments addressing actual diff code vs generic advice), false positive rate (% of comments flagging correct code). Think about which dimensions trade off against each other - higher coverage may mean more false positives.
Challenge 2: Build the Slopodar Eval Dataset (50 Samples)
Estimated time: 40 minutes Type: Build
Complete the slopodar eval dataset started in Section 8 of this step. Build a dataset of 50 examples in JSONL format for the classification task: given a text passage, identify which slopodar pattern (if any) it exhibits.
Deliverable: A file evals/slopodar/dataset_v1.jsonl containing 50 examples.
Design constraints:
- Use the schema from Section 8:
{"input": "...", "target": "...", "metadata": {...}} - Include at least 8 of the 11 slopodar patterns from the schema
- Include at least 10 “none” examples (clean text that does not exhibit any pattern)
- Include at least 5 edge cases: multi-pattern passages, borderline cases, or difficult “none” examples

Evaluation criteria:
- Labels are correct according to the slopodar detection heuristics
- The difficulty distribution includes easy, medium, and hard examples
- Edge cases test genuine boundary conditions (not just unusual formatting)
- The “none” class includes examples that could superficially resemble patterns but are clean
Design guidance
Start with the examples from Section 8. Then add: 5-8 pattern examples covering patterns not yet represented (redundant antithesis, epigrammatic closure, paper guardrail, deep compliance, not wrong). Write 8-10 “none” examples of varying difficulty - technical prose with numbers (tests tally voice specificity), honest methodology descriptions (tests epistemic theatre specificity), code with good assertions (tests right answer wrong work specificity). Add 3-5 edge cases: borderline between two patterns, very subtle patterns, and passages using trigger words that are actually clean.
For each example, verify your classification against the detection heuristic from
slopodar.yaml. If the heuristic says “search for X and check Y,” make sure your
label is consistent with that check.
Challenge 3: Synthetic Data Generation and Validation
Estimated time: 30 minutes Type: Build
Use an LLM to generate 200 synthetic eval examples from 20 hand-written seed examples. Then validate the generation quality.
Deliverable:

Design constraints:
- Use the seed examples from Challenge 2 (or from Section 8 if you did not complete Challenge 2)
- Generate examples in batches of 20-30 (not all 200 in a single prompt)
- Use a different model for generation than the model you intend to evaluate (if possible)
- Validate at least 40 examples manually (20% of 200)
Evaluation criteria:
- The generation prompt is well-structured (includes format instructions, diversity instructions, and distribution guidance)
- The validation is honest (reports real numbers, not optimistic estimates)
- The distribution comparison identifies any significant shifts
- The quality issues section identifies at least one concrete problem with the synthetic data
Design guidance
Use the generation function from Section 5, generating in batches of 20. For
validation, pick 40 examples at random and check: Is the input realistic? Is the label
correct per slopodar heuristics? Is the difficulty appropriate? For distribution
comparison, use the compare_distributions function from Section 5. Common issues:
overrepresentation of “easy” examples, underrepresentation of “none” class, near-
duplicates of seeds, incorrect labels on subtle examples.

Step 3 answers the next question: given a dataset and a model’s outputs, how do you compute the score? Step 3 covers the three grading approaches (code-based, LLM-as-judge, human evaluation) in order of preference, rubric design for LLM judges, the specific biases LLM judges introduce (position bias, verbosity bias, self-enhancement bias), calibration techniques, and custom scorer implementation. The dataset you build in this step becomes the input to the scorers you build in Step 3. Every scoring decision - what metric to use, what threshold to set, how to aggregate across dimensions - depends on the dataset being well-constructed. A well-designed scorer on a poor dataset amplifies the dataset’s flaws. A simple scorer on a good dataset produces actionable signal.
